The healthcare sector is witnessing rapid development in the field of artificial intelligence-powered medical diagnosis, with deep learning (DL) techniques gaining increasing attention in medical image analysis. The importance of this field lies in its ability to improve diagnostic accuracy, speed up the analysis process, and provide innovative solutions to the challenges faced by physicians in manual interpretation of medical images.
As part of this work, two enhanced Unet-based models were developed to improve the semantic segmentation accuracy of medical images. The first model deepens skip connections using additional convolutional layers to better preserve fine spatial detail without increasing computational cost. The second model uses a robust VGG19-based encoder, pre-trained on the ImageNet dataset, coupled with an enhanced decoder featuring deeper convolutional blocks for improved spatial resolution. Additionally, a preprocessing stage was introduced to investigate the impact of image enhancement on segmentation performance. Gaussian and median filters were applied separately for noise reduction, while CLAHE was employed for contrast enhancement. The experimental results showed an improvement in segmentation accuracy, proving the effectiveness of these architectural and preprocessing innovations.
To address the fundamental limitations of traditional convolutional architectures, particularly in capturing long-range dependencies, this work introduces a new model termed FGHQA-Unet, an innovative segmentation framework built upon the core Unet architecture with the integration of the Feature Global Hybrid Query Attention (FGHQA) mechanism. This mechanism relies on a hybrid attention framework that combines local and global representations, while employing a hybrid query representation that enhances the model’s ability to model fine-grained contextual relationships within medical images. Through this integration, the model overcomes the constraints associated with exclusive reliance on traditional convolutions by improving feature representation through the simultaneous fusion of precise spatial information and global context, thereby achieving an effective balance between representational accuracy and computational efficiency.
In addition, the adopted preprocessing strategy contributes to improving input data quality, reducing noise, and enhancing computational efficiency, which positively reflects on the model’s performance during both training and inference. The FGHQA-Unet architecture is designed to ensure a balance between computational accuracy and operational efficiency while maintaining the ability to extract fine-grained features in complex medical environments. The proposed model was evaluated on three benchmark medical segmentation datasets, BraTS, KiTS, and LiTS, where experimental results demonstrated its superiority over recent advanced methods in terms of segmentation accuracy and computational efficiency, confirming its effectiveness and practicality for DL–based medical imaging applications.
